FedBis/FedBiscuit is a federated learning framework that enables reinforcement learning with human feedback (RLHF) for large language models (LLMs) without compromising user privacy. This codebase—forked from [FederatedScope](https://github.com/alibaba/FederatedScope) and [FedBiOT](https://github.com/HarliWu/FedBiOT)—supports bfloat16 precision and MultiGPU training.

## Overview

**Key Features:**
- **Federated Preference Collection:** Each client trains a lightweight binary selector on local data. The server aggregates these selectors to simulate a large-scale preference dataset.
- **Two Training Phases:**  
  1. **Federated Preference Selector Training (FedBis):** Learn common user preferences via federated learning.
  2. **LLM Fine-tuning with RLHF:** Use the aggregated binary selector(s) to fine-tune a pre-trained LLM through reinforcement learning.

**Why FedBis/FedBiscuit?**
- **Privacy-Preserving:** Users do not need to share their raw preference data.
- **Computational Efficiency:** The binary selector avoids heavy computations compared with traditional reward model training.
- **Enhanced Alignment:** The aggregated selector improves the LLM’s content professionalism and readability.
- **FedBiscuit Extension:** To tackle preference heterogeneity and reward hacking, FedBiscuit clusters clients and trains multiple selectors for robust performance.

## Installation

Before you run the code, set up your environment and install FS-LLM (which is integrated into this repository). Follow these steps:

1. **Create a Conda Environment:**
   ```bash
   conda create -n fs-llm python=3.9
   conda activate fs-llm
   ```

2. **Install PyTorch (>=1.13.0):**
   ```bash
   conda install pytorch==2.0.0 torchvision==0.15.0 torchaudio==2.0.0 pytorch-cuda=11.7 -c pytorch -c nvidia
   ```

3. **Install FS-LLM in Editable Mode:**
   ```bash
   pip install -e .[llm]
   ```

You are now ready to use FS-LLM.

## Training

The training process is divided into two phases:

### Phase 1: Federated Preference Selector Training

1. **Prepare the Configuration File:**  
   Create a YAML file (e.g., `fedbiscuit_script/tldr/tldr_choice_gemma_fedbiscuit_u3.yaml`) with the settings for your task. An example configuration is shown below:

2. **Run the Training Script:**  
   Execute the training with your configuration:

### Phase 2: LLM Fine-tuning with RLHF

1. **Prepare the Fine-tuning YAML File:**  
   Create a YAML file (e.g., `fedbiscuit_script/tldr/tldr_rlhf_fedbiscuit_gemma.yaml`) for RLHF fine-tuning. An example configuration is:

2. **Run the RLHF Fine-tuning Script:**  
   Use the selector configuration file from Phase 1 (e.g., `fedbiscuit_script/tldr/tldr_choice_gemma_fedbiscuit_u3.yaml`) as an argument:

## Evaluation

Evaluation procedures vary with the task. Here are the two main setups:

### TLDR Summarization Task

1. **Run Summarization Evaluation on Different Checkpoints:**  
   Replace the checkpoint file name in the command accordingly.
   ```bash

2. **Run Auto-J Evaluation:**  
   To compare generated summaries with human annotations:

### SHP (Question Answering) Task

1. **Run QA Evaluation:**  
   ```bash

   After this command, an `alpaca_eval.json` file will be generated. You can then use GPT-4-turbo to compare the outputs.
