## Multi-Instance Serving (beta)

Encoders are memory-bound, not compute-bound — a single vLLM instance rarely saturates the GPU's compute capacity. `vllm-factory-serve` launches multiple vLLM instances on one GPU, each running its own continuous-batching scheduler, with a thin async dispatcher that distributes requests automatically. The result is up to 2x throughput with zero code changes.

When `--num-instances 1` (default), the command is equivalent to `vllm serve`. With N > 1, it launches N backend workers on consecutive ports and a lightweight reverse proxy on the user-facing port. GPU memory is automatically partitioned across instances.

## Why vLLM Factory?

Decoder-based LLM serving is a solved problem. Encoder-based serving is not.

Production traffic is heterogeneous: staggered requests at unpredictable intervals, mixed sequence lengths, variable batch sizes — none of it neatly padded or synchronized. Vanilla PyTorch pipelines (GLiNER, PyLate, SentenceTransformers) process requests sequentially or require manual batching. They block on each `model.forward()`, waste GPU cycles waiting for the next request, and have no scheduler to absorb traffic spikes.

**vLLM Factory bridges that gap.** Every bespoke encoder architecture — ColBERT, GLiNER, entity linking, multimodal retrieval — gets the same production-grade scheduling and memory management as a LLMs. No fork. No custom server. Just `vllm serve`.

Each plugin ships an **IOProcessor** that handles all pre- and post-processing inside the vLLM process. Clients send structured JSON (`{"data": {"text": ...}}` or `{"data": {"image": ...}}`), and the IOProcessor converts to model inputs, runs inference, and returns structured results. No client-side tokenization. No manual `extra_kwargs`. Just `POST /pooling`.

## Serving — all 12 models

Every plugin is served with `vllm serve` + `--io-processor-plugin`. The IOProcessor handles all tokenization, formatting, and output decoding server-side. Clients send simple JSON.

### Named Entity Recognition (GLiNER)

GLiNER models use custom model directories prepared by `forge/model_prep.py`. The IOProcessor handles all NER preprocessing (tokenization, span generation) and postprocessing (entity decoding) server-side.

## Parity — all 12 plugins validated

Every plugin passes end-to-end parity testing: `vllm serve` → HTTP request → compare against reference implementation. No smoke tests — real model inference, real outputs.

**NER models** are validated by comparing actual entity text and labels (not counts). The gating metric is **recall** — every reference entity must be found by vLLM. vLLM finding extra entities is acceptable. Entity confidence scores are compared informally (score deltas reported but not gating, since dtype rounding produces small drift).

**Embedding/ColBERT models** are validated by element-wise cosine similarity of the full output vector against reference tensors from the vanilla library.

All models run in **bfloat16**.

## How it works

### Architecture: FactoryIOProcessor + FactoryPooler

Each plugin registers a **FactoryIOProcessor** (subclass of vLLM's `IOProcessor`) for pre/post-processing and a **FactoryPooler** for task-specific business logic. A single **VllmPoolerAdapter** bridges pooler logic to vLLM's internal pooler ABC. No client-side tokenization needed.

The **FactoryPooler** protocol (`vllm_factory/pooling/protocol.py`) has zero vLLM imports — all pooler business logic is decoupled from vLLM internals. The **VllmPoolerAdapter** (`vllm_factory/pooling/vllm_adapter.py`) is the single coupling point.

## Building custom plugins

## Why it's fast

**Vanilla PyTorch blocks.** One `model.forward()` at a time. If request B arrives while request A is mid-inference, B waits. Under staggered, heterogeneous load — which is what production actually looks like — GPU utilization craters.

**vLLM schedules.** Incoming requests are continuously batched by the async scheduler. Variable-length sequences are packed efficiently via PagedAttention. CUDA graphs eliminate kernel launch overhead. The GPU stays saturated regardless of arrival pattern.

vLLM Factory brings this to every encoder architecture with zero custom serving code.

## Known Limitations (0.2.0)

### Runtime Monkey-Patches

Two scoped monkey-patches remain in 0.2.0. Both are idempotent, applied in model `__init__` (not at import time), and transparently documented in-code with "WHY / CHARACTERISTICS / UPSTREAM RESOLUTION" sections.

### GLiNER High-Concurrency Throughput

GLiNER models show 10–30% throughput reduction at high concurrency (c≥32) compared to 0.1.x on vLLM 0.15.1. This is attributed to vLLM 0.19's V1 engine IPC overhead for serializing `extra_kwargs` payloads over ZMQ. Single-request latency is on par or better. ColBERT models (which use `PassthroughPooler` and the native token embedding path) are not affected.

### Partial Benchmark Coverage

`colqwen3` and `nemotron_colembed` were verified for model loading and parity but not full-benchmark throughput tested in this release cycle due to environment constraints.
