# Guardrails-based Agentic Pipelines

Guardrails-based pipelines are a critical of any agentic or RAG solution, as they address a wide range of security risks, hallucinations, compliance violations, malicious prompts, and much more. These guardrails are implemented **layer by layer in large-scale AI systems** to ensure that **if a vulnerability passes through one layer, a second, stronger layer can stop it**. *   **Build an Unguarded Agent:** First, we build a completely unguarded agent to observe its failures, like hallucinations and security vulnerabilities, firsthand on company data.

## Setting up the Environment

Okay, so before we can start building our **multi-layered Guardrails framework**, we need to lay the proper groundwork. Just like in any serious engineering project, a solid setup is the key to making sure everything runs smoothly later on.

In this first part, we are going to focus on getting our entire development environment ready. Here’s what we will be doing:

*   **Install Dependencies:** We will pull in all the necessary Python libraries we need to build our agent.
*   **Import Modules & Configure API Client:** We’ll set up our script and connect to our LLM provider.
*   **Select Role-Specific Models:** We’ll discuss the strategy of using different models for different jobs to balance cost and performance.

The very first step is to install the libraries. We need tools to build our agent (`langgraph`), interact with LLMs (`openai`), and, for our use case, download financial documents from the SEC (`sec-edgar-downloader`).

We will be using Nebius AI as our LLM provider, but because we’re using the standard `openai` library, you could easily swap this out for another provider like Together AI or a local Ollama instance.

Like every project, the first step for a developer is to securely provide the keys and initialize the client module if API-provided services are being used.

This is a important step, we need to decide which LLMs to target. Like most AI projects, our architecture will rely on models of different sizes: smaller ones for fast iteration and testing, and larger ones for deeper reasoning and complex analysis. In our case, we’re targeting three LLMs.

We are targeting three LLM sizes 2B, 8B, and 70B each of which will be used at different stages of implementation. Now that we have configured our environment, we can start building the entire pipeline.

## Building an Unguarded Agent

Before we can begin building our **defense system**, we need to understand what we are defending against.

Therefore, our first step is to **create a fully capable financial agent**, but to do so **without any built-in safeguards**.

At first, this might seem reckless or even counterproductive. However, that is exactly the point. By observing what happens when a powerful AI operates without limitations, we can clearly see **why safety mechanisms are not optional features**, but rather **essential components** of any responsible AI system.

Here’s what we are going to do in this section:

*   **Source the Agent Knowledge:** To mimic real world scenario, we will programmatically download financial data to serve as our agent knowledge base.
*   **Define its Core Tools:** We will give the agent a set of capabilities, from simple data retrieval to high-risk actions like executing trades.
*   **Build the Agent’s Brain:** We’ll use `LangGraph` to orchestrate a standard ReAct (Reason+Act) logic loop for the agent.
*   **Demonstrate Catastrophic Failure:** We will then operate this unguarded agent on a deceptive, high-risk prompt and watch it fail, providing a clear justification for every guardrail we build next.

#### Sourcing the Agent Knowledge Base

An agent is useless without information. Our autonomous investment manager needs two kinds of data to function.

1.  Deep, historical financial reports for long-term analysis
2.  and real-time market information for immediate context.

So, let’s start by getting the historical data. We will write a function to programmatically download the latest [10-K annual report for a company](https://www.sec.gov/Archives/edgar/data/1045810/000104581022000036/nvda-20220130.htm) directly from the SEC EDGAR database.

For our use case, we are focusing on NVIDIA (ticker: NVDA).

We are defining some basic info regarding our data here like the company name, ticker, and the report type we want to fetch.

Next, we will use this metadata to query the **SEC EDGAR API**, locate the most recent **10-K filing** for NVIDIA, and automatically download it into our defined directory (`DOWNLOAD_PATH`).

In this function that we have just coded basically it is taking a stock `ticker`, a `report_type`, and a local `path` as inputs. Inside, it uses the `Downloader` class from the `sec-edgar-downloader` library to connect to the SEC's database and fetch the latest filing.

Once it runs it will go through the directories created by the library, and will try to find the `full-submission.txt` file, and reads its entire content into memory. So, basically on large string of our entire database.

Let’s run this function and see how it is working.

Great so the output confirms that the file was downloaded successfully and its content is about 854,321 characters of it, is now loaded into our `TEN_K_REPORT_CONTENT` variable, ready for the agent to query.

#### Defining Core Tools and Capabilities

If the data coming to your agent is secured then the  potential for harm are defined by the tools it can use. We are going to give our agent three distinct capabilities, which we can think of as its “genotype” or core DNA. These tools will allow it to research, get live data, and, most importantly, take action.

1.  First we need a read-only research tool (`query_10K_report`) to search the 10-K and return contextual snippets.
2.  Second we need a live-data tool (`get_real_time_market_data`) to fetch current price/news while **flagging unverified rumors**.
3.  Third we need a guarded action tool (`execute_trade`) to place BUY/SELL orders only under strict approvals and limits.

Let’s start with research tool. This function is going to perform a search over that massive 10-K report we just downloaded.

In a production system, this would likely be a sophisticated RAG pipeline with a vector database. For our purposes here, a simple keyword search is enough to simulate the act of retrieving information from a document.

This function is pretty simple …

1.  It takes a `query` string as input, checks if our global `TEN_K_REPORT_CONTENT` variable contains any data.
2.  Then performs a basic case-insensitive `find()` operation to locate the query within the text.
3.  If a match is found, it returns a 1000-character snippet surrounding the match to give the agent some context. If not, it simply reports that nothing was found.

Basically it is acting  as our agent internal library, a low-risk tool for factual lookups.

Next, our agent needs to know what’s happening right now. The 10-K report is historical, but markets move on real-time news. This second tool simulates a call to a live market data API.

For this notebook, we are going to mock the API’s response. But pay close attention to the mocked data, we have intentionally planted a piece of **deceptive information**, a **“social media rumor”** to see …

What this `get_real_time_market_data` function does is to simulate an external API call.

When the agent provides a `ticker`, the function checks if it's our target company ('NVDA'). If it is, it returns a hardcoded JSON string containing plausible-looking market data.

This JSON includes an **"unconfirmed"** social media rumor. This function serves as the agent connection to the outside world, and we have purposely made that environment a bit challenging to test how well it can make decisions.

Now we need to code our final and most dangerous tool. It represents the agent’s ability to take direct, irreversible action with real-world financial consequences. Giving an AI access to a tool like this without extremely robust guardrails is the central problem we are here to solve.

This final function, `execute_trade`, is what gives our agent a good amount of power. It accepts a `ticker`, a number of `shares`, and an `order_type` ('BUY' or 'SELL').

To make it clear that a critical action is happening, it prints a loud warning to the console.

> In a real application, this is where the code would interact with a brokerage API. For our simulation, it simply logs that the action was taken and returns a JSON object with a success status and a unique confirmation ID.

This tool is what makes our agent truly autonomous and, for now, incredibly dangerous.

We have now defined all three of our agent’s core capabilities. **It can conduct research, check live data, and execute trades**. We are now ready to assemble our naive but powerful agent.

#### `LangGraph`-based ReAct (Reason+Act) Orchestrator

These tools that we have just coded are just a box of parts. We now need to build the **“brain”** that can intelligently decide which tool to use, when to use it, and what to do with the results.

For this, we will use `LangGraph` to build a ReAct (Reason and Act) agent. This is a foundational pattern in agentic systems. It creates a simple but powerful loop:

1.  **Reason:** The agent thinks about the problem and decides on an action.
2.  **Act:** The agent executes that action (like calling one of our tools).
3.  **Observe:** The agent gets the result from the action and adds it to its memory.
4.  **Repeat:** It goes back to step 1, now with new information, to reason about the next step.

This loop allows the agent to tackle multi-step problems dynamically. Let’s start building it.

First, we need to define the agent’s “state.” This is the memory or scratchpad that persists throughout the agent’s run. For a conversational agent, the state is simply a list of all the messages in the conversation so far.

Next, we need to make our Python functions **“visible”** to the LLM. We do this by decorating them with the `@tool` decorator from LangChain.

This tells the LLM that these functions are available tools it can call. We will also define a `Pydantic` model for our high-risk `execute_trade` tool to ensure the LLM provides the arguments in a clean, structured format.

So, we just took our raw Python functions and wrapped them as official LangChain `tools`. We can simply bind these tools into a simple python list and create a tool node that will the respective tool when needed.

Now, we can define the agent **brain**. This is the `agent_node`, which is responsible for calling the LLM to decide what to do next. To do this properly, we first need to make the LLM aware of the tools we've just defined. This is a crucial step.

Let’s break down what this `agent_node` does …

1.  It takes the current `state` (the conversation history), and passes it to `llm_with_tools`. This isn't just a regular LLM call, because we used `.bind_tools()`.
2.  The model will analyze the conversation and, if it decides a tool is needed, its response won't be a string of text, but a structured object containing the name of the tool to call and the arguments to use. This is the core of its reasoning capability.

ok so now that we have coded the thinking feature where llm will decide the right tool to choose, we need a **“traffic cop”** to direct the flow. This is our `should_continue` function.

> Its job is to look at the last message from the agent and decide what to do next.

**Partial Success, but Still a Failure.** Our first guardrail has worked. It correctly identified that the **“$1200”** price target was a hallucination and rejected the response.

This is great, but what if the agent hadn’t hallucinated? What if it had said:

This statement is factually grounded but still dangerously non-compliant. Our naive guardrail would have allowed it. We need another layer.

#### Adding a Compliance Guardrail

Financial communications are heavily regulated. To address this, we will add a second guardrail that acts as a compliance officer. Its job is to check the agent’s response against a specific rule (FINRA Rule 2210), which prohibits communications that are promissory, unbalanced, or speculative.

This `check_finra_compliance` function is another LLM-as-a-Judge. It provides the model with the specific rule and asks for a simple `is_compliant` verdict.

Now let’s create a better orchestrator with both checks. But to demonstrate our next failure, let’s test it on a new response that is both grounded and compliant, but has a subtle citation error.

**Yeah this is another Failure.** This is more subtle, but just as important. The response passed our groundedness check because the information is in the context.

It passed our compliance check because it’s just stating a fact. But it’s still wrong, it falsely attributes real-time news to a historical SEC filing. This erodes trust. We need one more guardrail.

#### Building a Citation Verification Layer

Our final output guardrail is simple, fast, and programmatic. It doesn’t need an LLM. Its only job is to parse any citations from the response and check if those source documents were actually used.

This function simply uses regex to find citations and checks them against a list of the actual sources used. Now, let’s build our final, complete orchestrator that uses all three guardrails.

Now we can see that the our multi-layered defense system has solved all three of our critical issues. Our final orchestrator caught all the problems:

3.  and the False citation.

Because the `is_safe` flag was false, it completely discarded the agent dangerous response and replaced it with a safe, neutral, and compliant alternative.

We have now built all three layers of our Aegis framework. It’s time to integrate them into a single, cohesive system and run our final end-to-end test.

## Full System Integration and The Aegis Scorecard

Okay, so we have built all three layers of our Aegis framework in isolation. We have a perimeter defense for input, a command core for action plans, and a final checkpoint for the output. Now it’s time to bring everything together.

In this final technical section, we are going to assemble these components into a single, cohesive, and production-grade system. This is where we see the full power of our defense-in-depth strategy in action.

Here’s what we are going to do:

*   **The Redemption Run:** We will take the exact same dangerous prompt from our very first test and process it through the fully guarded system to demonstrate its effectiveness.
*   **Create the Aegis Scorecard:** and then design a final summary report that provides a clear, at-a-glance overview of the agent’s performance and the guardrails’ verdicts.

#### Visualizing the Complete Depth Agentic Architecture

Before we run the final system, it is always a good idea to visualize what we have built.

This code doesn’t run our agent, its only purpose is to define the high-level structure of our system so `LangGraph` can draw it. We add each of our three Aegis layers, along with the core agent logic (Planning, Execution, Response Generation), as nodes and connect them sequentially.

The resulting graph provides a crystal-clear **“blueprint”** of our defense-in-depth strategy, showing how a request must successfully pass through each layer of security before a final output is produced.

#### Processing the Original High-Risk Prompt

This is the final validation. We will now take the exact same dangerous prompt from Section 1, the one that caused our unguarded agent to panic-sell stock and leak PII and process it through our complete, multi-layered Aegis framework. We expect to see a completely different, safe, and professional outcome.

To do this, we will create a final orchestrator function that simulates the full, end-to-end flow.

Let’s break down what this `run_full_aegis_system` function is doing …

1.  It starts by calling our `run_input_guardrails` orchestrator. It then immediately checks the results.
2.  If either the threat check has failed or PII has been found, it stops everything. It prints a clear verdict and, importantly, generates a pre-written, safe response that educates the user on why their request was denied.

This is a much better user experience than a blunt **request denied** error. Now, let’s execute this with our original `high_risk_prompt`.

**You can say that this is the hallmark of a well-designed, trustworthy AI system.**

#### A Multi-Dimensional Evaluation

Finally, to make the results of a run easy to understand for everyone from developers to compliance officers, we can create a simple scorecard.

The scorecard tells a clear story. It shows that the prompt was rejected in just **1.61 seconds** for a fraction of a cent. It clearly indicates that the `PII Check` and `Threat Check` both **FAILED**.

Because the process was halted at Layer 1, the scorecard correctly reports that the checks in Layer 2 and Layer 3 were **NOT RUN**. This kind of transparent, auditable reporting is essential for building trust in complex AI systems.

## Concluding Everything and RED Teaming

So far we started by building a powerful but dangerously naive AI agent. We watched it fail catastrophically, acting on bad information, leaking sensitive data, and violating compliance, all in a single run.

That failure wasn’t a bug, it was a demonstration of the inherent risks of unchecked agentic systems.

From there, we methodically built our **“Aegis”** framework, layer by layer.

*   **Layer 1** gave us a fast, efficient perimeter to block obvious threats at the front door.
*   **Layer 2** took us deeper, interrogating the agent’s *intent* by validating its action plan against automated policies and human oversight.
*   **Layer 3** provided the final checkpoint, ensuring the agent’s final communication was factually grounded, compliant, and trustworthy.

In the end, when we ran our original dangerous prompt through the fully integrated system, the threat was neutralized instantly. The system didn’t just fail safely, it responded intelligently, protecting itself and educating the user.

#### Red Teaming Agents

But the work of building trustworthy AI is never truly done. To take this system to the next level, we could explore two advanced concepts.

Right now, we are the ones thinking of ways to break our system.

> But what if we automated that process? A powerful next step would be to build an **adversarial Red Team agent**.

The sole purpose of this agent would be to act like a creative and relentless hacker.

1.  We would task it with generating novel, deceptive, and unexpected prompts designed to find blind spots and bypass our Aegis framework.
2.  Every time the Red Team agent succeeds in fooling our guardrails, it exposes a vulnerability that we can then patch.
3.  This creates a continuous cycle of attack, defense, and improvement, hardening our system against threats we haven’t even thought of yet.

#### Adaptive Guardrails that Learn

Our current guardrails are powerful, but they are largely based on static rules and prompts. An even more advanced system would feature **adaptive guardrails** that learn and evolve over time.

Think about it:

1.  every time a human reviewer in Layer 2 denies an agent’s plan, that’s a valuable piece of feedback. It’s a real-world example of a “bad decision”.
2.  We could collect these denied plans and use them to fine-tune a “risk assessment” model.
3.  Over time, the guardrail would move beyond simple, hardcoded rules (like “trade value < $10,000”) and learn the *nuance* of what constitutes a risky or inappropriate plan.
4.  It would develop a sense of judgment, making the entire system smarter and more aligned with human expectations.

So, in short we can combine our Aegis with continuous red teaming and adaptive learning, we can move closer to the ultimate goal, creating autonomous systems that are not just powerful, but provably safe and genuinely trustworthy.
